Can someone confirm the following?

When using the Deep-Sleep or Power-Down modes on the LPC1800, we lose JTAG/SWD debug access. Debugging does not return when we wake up from Deep-Sleep or Power-Down modes.

Correct?

I am using the LPC1837 evaluation board with the LPXpresso IDE.

Yes, that's normal. The User Manual mentions this:

Due to limitations of the Cortex-M4 integration, the LPC43xx cannot wake up in the
usual manner from Deep Sleep and Power-down modes. Do not use these modes
during debug.

At least the debuggers from LPCXpresso or Keil or IAR will not survive these modes, they don't accept that the chip is not longer reachable.
I think that a debugger like the one from Lauterbach is mor eflexible in that, but you pay the price   8-)
